  • Observability: logging, tracing, and evaluation platforms

Start with a simple spreadsheet:

That number is useful because it lets you compare models, optimize prompts, and decide if the task is worth automating.


Benchmarking protocol

1. Pick representative tasks Do not benchmark on toy examples. Use real tasks from your backlog.

2. Run each task 10 times Record tokens in, tokens out, latency, and success rate for each run.

3. Test multiple models Run the same task through:

  • A frontier model (GPT-4o, Claude 3.7)
  • A mid-tier model (GPT-4o-mini, Claude 3.5 Haiku)
  • A local model (Qwen3.5, Llama 3.1)

4. Score quality Quality matters. A cheaper model that fails 30% of the time is not cheaper.

5. Project to volume Multiply the per-task cost by expected monthly volume. Add subscriptions, storage, and compute.

Cost control tactics

1. Route by task difficulty. Use a cheap model for simple tasks and an expensive model only for hard ones. LiteLLM or Portkey makes this easy.

2. Cache repeated prompts. If your agent asks the same question repeatedly, cache the answer. LiteLLM, Portkey, and some frameworks support semantic caching.

3. Shorten prompts. Every token counts. Remove unused context, examples, and instructions.

4. Reduce output length. Ask for concise answers. Long outputs cost more and can obscure the point.

5. Batch tool calls. Combine requests to external APIs. One batched search beats ten separate ones.

6. Set budget caps. Use provider dashboards or gateways to set monthly or per-key spending limits.

7. Monitor daily. Cost drift is real. A daily cost check catches runaway loops before they become invoices.

  • You use one model for everything. Model routing saves money without hurting quality.
  • You ignore free tiers. Many tools have generous free tiers for prototypes.
  • You benchmark once. Workloads change; re-benchmark quarterly.
  • You optimize only tokens. Subscriptions and compute can dwarf inference.
